Following this, we can create the logical propositions for the individual movies and use our knowledge base to evaluate the said logical propositions as FALSE. So far, we have discussed what we understand by symbols and how we can describe their interactions using relations. The final puzzle is to develop a way to feed this information to a machine to reason and perform logical computation. We previously discussed how computer systems essentially operate using symbols.
This attribute makes it effective at tackling problems where logical rules are exceptionally complex, numerous, and ultimately impractical to code, like deciding how a single pixel in an image should be labeled. In principle, these abstractions can be wired up in many different ways, some of which might directly implement logic and symbol manipulation. (One of the earliest papers in the field, “A Logical Calculus of the Ideas Immanent in Nervous Activity,” written by Warren S. McCulloch & Walter Pitts in 1943, explicitly recognizes this possibility). Training an AI chatbot with a comprehensive knowledge base is crucial for enhancing its capabilities to understand and respond to user inquiries accurately and efficiently.
Other methods rely, for example, on recurrent neural networks that can combine distributed representations into novel ways [17,62]. In the future, we expect to see more work on formulating symbol manipulation and generation of symbolic knowledge as optimization problems. Differentiable theorem proving [53,54], neural Turing machines [20], and differentiable neural computers [21] are promising research directions that can provide the general framework for such an integration between solving optimization problems and symbolic representations. Recently, there has been a great success in pattern recognition and unsupervised feature learning using neural networks [39]. This problem is closely related to the symbol grounding problem, i.e., the problem of how symbols obtain their meaning [24]. Feature learning methods using neural networks rely on distributed representations [26] which encode regularities within a domain implicitly and can be used to identify instances of a pattern in data.
Problems were discovered both with regards to enumerating the preconditions for an action to succeed and in providing axioms for what did not change after an action was performed. Similarly, Allen’s temporal interval algebra is a simplification of reasoning about time and Region Connection Calculus is a simplification of reasoning about spatial relationships. Let’s just note that the digital computer is the tool with which every researcher in artificial intelligence, whether they work inside the Symbolic AI tradition or not, now works. The following resources provide a more in-depth understanding of neuro-symbolic AI and its application for use cases of interest to Bosch. It follows that neuro-symbolic AI combines neural/sub-symbolic methods with knowledge/symbolic methods to improve scalability, efficiency, and explainability. In the history of the quest for human-level artificial intelligence, a number of rival paradigms have vied for supremacy. Symbolic artificial intelligence was dominant for much of the 20th century, but currently a connectionist paradigm is in the ascendant, namely machine learning with deep neural networks. However, both paradigms have strengths and weaknesses, and a significant challenge for the field today is to effect a reconciliation. A central tenet of the symbolic paradigm is that intelligence results from the manipulation of abstract compositional representations whose elements stand for objects and relations. If this is correct, then a key objective for deep learning is to develop architectures capable of discovering objects and relations in raw data, and learning how to represent them in ways that are useful for downstream processing.
In other words, I do expect, also, compliance with the upcoming regulations, less dependence on external APIs, and stronger support for open-source technologies. This basically means that organizations with a semantic representation of their data will have stronger foundations to develop their generative AI strategy and to comply with the upcoming regulations. There has been recently a regain of interest about the old debate of symbolic vs non-symbolic AI. The latest article by Gary Marcus highlights some success on the symbolic side, also highlighting some shortcomings of current deep learning approaches and advocating for a hybrid approach. I am myself also a supporter of a hybrid approach, trying to combine the strength of deep learning with symbolic algorithmic methods, but I would not frame the debate on the symbol/non-symbol axis. As pointed by Marcus himself for some time already, most modern research on deep network architectures are in fact already dealing with some form of symbols, wrapped in the deep learning jargon of “embeddings” or “disentangled latent spaces”.
Programs were themselves data structures that other programs could operate on, allowing the easy definition of higher-level languages. The key AI programming language in the US during the last symbolic ai boom period was LISP. LISP is the second oldest programming language after FORTRAN and was created in 1958 by John McCarthy. LISP provided the first read-eval-print loop to support rapid program development. Program tracing, stepping, and breakpoints were also provided, along with the ability to change values or functions and continue from breakpoints or errors.
RTT is far more all-encompassing than NLP as a treatment method. While learning how to communicate with your mind is an important part of the method, it is often not enough if someone has experienced severe trauma, emotional hurt, or disconnection. You can't fix what you don't understand.
Relations allow us to formalize how the different symbols in our knowledge base interact and connect. Don’t get me wrong, machine learning is an amazing tool that enables us to unlock great potential and AI disciplines such as image recognition or voice recognition, but when it comes to NLP, I’m firmly convinced that machine learning is not the best technology to be used. This is a nice coupling of statistical evaluation (with all its approximations, but for a fitness it is acceptable) and formal structure evolution, which comes with many computational advantages once the final grammar has been stabilized.
The role of humans in the analysis of datasets and the interpretation of analysis results has also been recognized in other domains such as in biocuration where AI approaches are widely used to assist humans in extracting structured knowledge from text [43]. The role that humans will play in the process of scientific discovery will likely remain a controversial topic in the future due to the increasingly disruptive impact Data Science and AI have on our society [3]. Inspired by progress in Data Science and statistical methods in AI, Kitano [37] proposed a new Grand Challenge for AI “to develop an AI system that can make major scientific discoveries in biomedical sciences and that is worthy of a Nobel Prize”. Before we can solve this challenge, we should be able to design an algorithm that can identify the principle of inertia, given unlimited data about moving objects and their trajectory over time and all the knowledge Galileo had about mathematics and physics in the 17th century.
The Life Sciences are a hub domain for big data generation and complex knowledge representation. Life Sciences have long been one of the key drivers behind progress in AI, and the vastly increasing volume and complexity of data in biology is one of the drivers in Data Science as well. Life Sciences are also a prime application area for novel machine learning methods [2,51]. Similarly, Semantic Web technologies such as knowledge graphs and ontologies are widely applied to represent, interpret and integrate data [12,32,61]. There are many reasons for the success of symbolic representations in the Life Sciences. Historically, there has been a strong focus on the use of ontologies such as the Gene Ontology [4], medical terminologies such as GALEN [52], or formalized databases such as EcoCyc [35].
Prominently, connectionist systems [42], in particular artificial neural networks [55], have gained influence in the past decade with computational and methodological advances driving new applications [39]. Statistical approaches are useful in learning patterns or regularities from data, and as such have a natural application within Data Science. As far back as the 1980s, researchers anticipated the role that deep neural networks could one day play in automatic image recognition and natural language processing. It took decades to amass the data and processing power required to catch up to that vision – but we’re finally here.
Neuro-symbolic approaches carry the promise that they will be useful for addressing complex AI problems that cannot be solved by purely symbolic or neural means. We have laid out some of the most important currently investigated research directions, and provided literature pointers suitable as entry points to an in-depth study of the current state of the art. We investigate an unconventional direction of research that aims at converting neural networks, a class of distributed, connectionist, sub-symbolic models into a symbolic level with the ultimate goal of achieving AI interpretability and safety.
